Problem 8: Parallel Counting - Histogram Computation

In this problem, we explore a new parallel computing pattern: histogram computation. This involves atomic operations, which are essential tools for handling conflicts when multiple threads need to simultaneously update the same memory location.

Histograms

Histograms are among the most fundamental and important tools in statistics, used to count the frequency of different values in a dataset. When we attempt to accelerate histogram computation using parallel computing, we encounter data race conditions: multiple threads may try to increment the same counter simultaneously, potentially leading to incorrect results.

Consider a simple scenario: you're counting how many times each value appears in a dataset. In a single-threaded environment, this is straightforward:

    histogram[data[i]]++;

This code is logically clear and correct, but lacks efficiency when processing large-scale data. Naturally, we might think of using GPUs to parallelize this process. So we write a simple CUDA kernel to handle the data:

While this appears reasonable on the surface, the seemingly simple line histogram[value]++; actually consists of three separate steps: read the current value, increment by one, and write back the new value.

The problem arises: what happens if two threads execute this simultaneously?

In the example above, two threads almost simultaneously read the same counter value of 5, then each increments it by 1 and writes it back. This results in an incorrect final value of 6, with one increment operation lost.

This phenomenon is called a race condition, making naive parallel histogram computation unreliable. On GPUs, with thousands of threads running simultaneously, the probability of such conflicts increases dramatically, potentially leading to completely erroneous results.

Atomic Operations

The key to resolving race conditions lies in atomic operations. Atomic operations guarantee that the read-modify-write sequence cannot be interrupted by other threads, essentially placing an indivisible "protective shield" around the operation.

In CUDA, we can use the atomicAdd function to safely increment counters:

atomicAdd(&histogram[value], 1);

This function ensures that at any given moment, only one thread can modify the specified memory location. Other threads attempting to access the same location must wait until the current operation completes.

CUDA provides a rich set of atomic functions to meet different needs:

atomicAdd(&address, value);    // address += value
atomicSub(&address, value);    // address -= value  
atomicMax(&address, value);    // address = max(address, value)
atomicMin(&address, value);    // address = min(address, value)
atomicCAS(&address, old, new); // Compare-and-swap

Balancing Performance and Correctness

While atomic operations solve the correctness problem, we need to consider their performance implications. When many threads compete for the same memory location, they're effectively forced to execute serially, losing the advantages of parallel computation.

More importantly, the degree of performance degradation largely depends on the distribution characteristics of the data. If data is uniformly distributed across all histogram bins, conflicts are relatively few and performance remains acceptable. However, if most data concentrates in a few bins, these hotspot bins become severe performance bottlenecks, with numerous threads queuing to access the same locations.

To maximize performance while ensuring correctness, we can employ a "hierarchical strategy." The core idea of this strategy is "divide and conquer": solve the problem locally first, then merge global results.

The first level involves block-level processing. Each thread block uses shared memory to build its own private histogram. Since shared memory access is much faster than global memory, the cost of performing atomic operations on shared memory is relatively small. Threads within each block collaborate to process their assigned data, accumulating results in the block's private histogram.

The second level involves global-level merging. After all blocks complete their local computations, they need to merge their private histograms into the final global histogram. While we do need to use global memory atomic operations at this stage, the key difference is that the number of atomic operations per bin is now greatly reduced—from "one per data element" to "one per block."

This strategy is like organizing a large-scale vote count: instead of having all voters crowd around a single ballot box, we establish polling stations in each community, first count results within each community, then aggregate results from all communities. This approach improves efficiency while ensuring accuracy.

Generally, fewer blocks lead to better performance since shared memory is much faster than global memory. We can find the optimal balance by adjusting the number of threads per block.

Code Implementation

Now please implement the hierarchical histogram computation described above using CUDA in student.cu. The input data consists entirely of integers between 0-255.
